the story that's inside the gameplay part of the game is conversations that bookend stages. There are also a couple of fighting games with have the same. You can always read the Touhou Wiki, or if you are really desperate and have no shame, Tvtropes.

Don't force yourself to do something you don't like. You can read the Touhou wiki like some sort of textbook to learn about the characters and whatever, but that's stupid and you won't get any fun out of it. There isn't really any story or plot that you're missing out on anyway, so you might as well just try to find some fanmade stuff that you like if you want to "get into 2hu." In any case, you're not missing out on anything since it's all shit and pretty close to being dead now.

Check out Airospace.
For the more classic hip-hop experience look into the Wu-Tang Clan, DJ Shadow, Nas, early Snoop Dogg and just about everyone you can find with a 3 minute google search.

Death Grips, Yung Lean, Lil B and O.T. Genasis are the obvious choices if you're looking for something a little more meme-y.
O.T. is really great, despite having made the most meme hip-hop banger of 2014.

Most of the dialogue in the shmups is just pre-fight banter. The fighting games have more, but most of the exposition comes from the books and manga. One of these, Perfect Memento in Strict Sense, was written as an in-universe encyclopedia and has an English translation at touhouwiki.net

Just note that, since it's written from the perspective of a Touhou character rather than ZUN himself, it deliberately has a few mistakes and omissions related to things that most 2hus don't know about.
